I usually have headphones on, but whenever the system is not charging and no audio being played, I hear a lot of bad noise, which forces me take the headphones on and off all the time.
Is there any fix for this?

the sort of noise you describe might be coming from the internal microphone

I finally found the source of the problem, I have a USB mouse connected to the laptop which causes both the constant noise and the intermittent beep (whenever the mouse moves).
The strange part is that plugging the charger (or playing audio) magically mutes all of it.

Update, Ad-hoc solution:
For now connecting the USB mouse to the USB port on the opposite side of the headphone jack, resolves the problem.
I was looking in alsamixer to see if audio playback from the microphone was unmuted and turned up in alsamixer, but it is not
you appear to have found the cause of the problem with the mouse and USB socket
a different mouse might not cause the same audio interference
replacing the laptop battery might supply better power to the system to prevent this happening
but switching to another USB socket works without replacing anything
I’m not sure since this was a while ago, but I guess on Windows, either the audio driver or the system prevented this from happening, so is there any way to force the system to do this?
There is this suggestion from Archwiki to turn off power saving for the audio device

modprobe snd_hda_intel power_save=0
but this may not work for you with constant noise source
This may help to keep the audio device active by creating an inaudible subsonic audio stream

and set the volume of this module to 0 so it does not affect other audio streams
